Eval-Driven Development: How to Build Automated CI/CD Regression Tests for LLMs

Moving beyond subjective vibe checks: implementing deterministic benchmark suites, LLM-as-a-judge guardrails, and automated release gates in GitLab and GitHub Actions.

In traditional software engineering, modifying a function requires unit and integration test passes before deployment. In AI engineering, prompt tweaks and model upgrades are still frequently deployed based on 'vibe checks'—an engineer inspecting two sample outputs and concluding 'it looks pretty good.'

Vibe checks do not scale in enterprise production. A minor prompt change designed to improve customer greeting tone can silently degrade JSON output parsing or increase hallucination rates in edge cases.

Eval-Driven Development (EDD) establishes automated regression test suites for generative AI pipelines. Every model pipeline is accompanied by a versioned benchmark dataset containing hundreds of paired inputs, ground-truth facts, and expected output schemas.

Automated evaluation employs a tiered scoring approach: 1) Deterministic Unit Checks: Exact schema validation, JSON linting, and forbidden keyword regex; 2) Semantic Similarity: Embedding cosine thresholds and ROUGE/BLEU scores; 3) LLM-as-a-Judge: Multi-rubric scoring using strict, temperature-zero frontier models assessing faithfulness, relevance, and tone of voice. When test pass rates drop below predetermined thresholds (e.g. 98.5%), CI/CD build pipelines automatically block deployment.
